But the real danger lies elsewhere: when an AI system is confidently wrong. A prediction made with misplaced certainty can trigger decisions that no amount of downstream correction can undo. In the world of autonomy, the risk goes beyond a mere error: this is an error dressed up as conviction. 

For Neha Boloor, a seasoned machine learning engineer whose deep expertise spans from generative AI to simulation to scalable ML infrastructure, and a recognized Business Intelligence Judge, the next frontier in autonomy is neither raw speed nor accuracy. Instead, the new vista is teaching machines the discipline of doubt. “The hardest failures in autonomy are contrary to when the model is wrong: instead, they occur when the model is wrong but convinced it is right,” she reflects. That philosophy now guides her approach to designing safety-critical AI systems. 

Why Uncertainty Is the True Test of Autonomy 

Every AI system must contend with uncertainty, but in safety-critical domains, its management determines trust. Researchers often distinguish between two kinds: aleatoric uncertainty, which stems from the noise inherent in sensor data (fogged cameras, partial occlusions); and epistemic uncertainty, which is rooted in what the model has never seen before. Autonomous vehicles encounter both daily: let’s say, an unpredictable pedestrian who darts into the road or a rare lighting-and-weather combination that confuses perception. 

Decisive action becomes risky when model confidence is miscalibrated. Foundational research shows modern neural networks are often overconfident, and that post‑hoc calibration and uncertainty quantification improve reliability. Practical approaches like deep ensembles and out‑of‑distribution detection baselines help systems recognize when inputs diverge from training distributions. Public reporting frameworks such as the California DMV’s disengagement reports underscore the industry’s focus on understanding system limits, though they are not designed to attribute root causes or compare companies. 

Her career has consistently explored these edge cases, through her work in generative AI and simulation pipelines—a theme she advanced as a keynote speaker at the IEEE ICSCIS 2025, Malaysia, presenting “Vision Zero: Leveraging AI and Advanced Datasets for Safer, Smarter Roadways.” Neha has helped reveal how long-tail, rare-event scenarios stress models in ways traditional datasets cannot. The failures are instructive, but only if the system is engineered to recognize them as signals rather than statistical noise. 

Engineering Doubt: Designing Systems That Know Their Limits 

How does one design an AI that can admit uncertainty? Researchers have turned to Bayesian ensembles, dropout-based approximations, anomaly detection frameworks and calibration techniques to better align model confidence with reality. But Neha believes the more profound challenge is architectural: building systems that output probabilities and, better yet, are designed to act conservatively when confidence dips below safety thresholds. 

Her earlier work in consumer robotics provides a tangible case study. Recognized with the Titan Innovation Gold Award for Innovation in Technology, Neha developed the autonomous house exploration algorithm for a vision-only cleaning robot. Mapping a previously unseen home environment was more than a mere technical step: it was the very first impression a user had of the product. Early versions explored too slowly or clumsily, undermining trust. Neha re-engineered the system using a modular behavior tree approach in Rust, tripling exploration speed and halving mapping time. But the real leap was in teaching the robot how to navigate uncertainty. 

When the robot encountered an ambiguous environment, let’s say, a narrow hallway or an unfamiliar object, it was designed to think things out: to pause, reconsider or redirect rather than push forward blindly. “Uncertainty is far from a weakness in AI systems: instead, it is a signal, one we can engineer around,” Neha explains. That philosophy transformed the robot’s behavior from hesitant to intentional, and customers noticed the difference immediately. What looked like a small adjustment in code became a lesson in human perception of machine intelligence: confidence built on doubt. 

From Household Robots to Self-Driving Cars – Scaling the Philosophy 

The lessons from household robotics scale naturally into more complex domains like autonomous driving. In both cases, systems face unstructured environments filled with the unknown. Neha’s current work in diffusion models, 3D data learning and dataset generation pipelines extends that philosophy to the AV stack, ensuring predictive models go beyond a mere blind extrapolation and, above all, evaluate their own reliability. 

For instance, she has contributed to productionizing AI pipelines where synthetic data supplements long-tail scenarios like, let’s say, urban night driving, rare traffic conflicts or unusual agent interactions. But the true innovation lies in how these pipelines are integrated: models are trained to perceive and, better still, to question their own outputs when inputs deviate from expectation. That awareness translates into planning systems that can slow down, expand safety buffers or escalate control when the world behaves unexpectedly. 

By bridging simulation, generative AI and scalable infrastructure, Neha helps design systems that prioritize robustness over bravado. “In safety-critical AI, restraint is as important as action,” she says. “Teaching a system to pause, and to reconsider, is what makes it reliable at scale.” It is a stance that directly addresses the growing scrutiny from regulators and the public alike. As autonomy scales into real-world deployment, the expectation is shifting: machines must act quickly and, better yet, know when not to act at all. 

The Future of Trustworthy Autonomy 

The industry conversation around autonomy has long celebrated decisive performance: higher accuracy, lower latency and smoother control. But Neha argues that the true marker of progress will be how gracefully systems handle uncertainty. Rather than come from machines that act flawlessly every time, trust will come from those that know when to step back. 

“We earn trust when AI knows when to step back rather than when it acts perfectly,” she notes. It is a philosophy she has carried from consumer robotics to AV systems and from simulating rare edge cases to building production pipelines that anticipate failure. 

Her vision is clear: rather than by raw prediction speed, the future of autonomy will be defined by engineered humility. In a world where overconfidence is the most dangerous bug, teaching machines the art of uncertainty may prove to be the most important breakthrough of all.
